The formation of natural diamond requires very specific conditions that are met in two places on Earth: in the lithospheric mantle and at the site of a meteorite strike.
In reality, diamonds are not scarce at all! We have plenty of them but it just so happens that in the 19th century a marketing company called N.W. Ayer started a massive campaign trying to get people to use diamonds, a resource they had plenty of, as a symbol of love and affection that should cost around 2-3 times your monthly salary!
The trends caught on and people today live with the belief that diamonds are scarce and precious!
